Challenges in AI Interpretability: The Dilemma of Using Formal Specifications

As artificial intelligence and autonomous systems continue to permeate our daily lives, the quest for methods to ensure their predictability and interpretability has gained momentum. One such approach, formal specifications, hinges on mathematical formulations that can be translated into human-readable language. This technique is believed to hold the key to unraveling the decisions made by AI systems in a way that is comprehensible to humans.
However, a recent study conducted by researchers at MIT Lincoln Laboratory suggests that formal specifications may not be as interpretable by humans as initially thought. The study's findings have raised questions about the practicality of this approach, shedding light on potential challenges in achieving genuine AI interpretability.
The research, led by Hosea Siu, a laboratory AI Technology Group member, serves as a wake-up call to the AI community. Siu emphasizes, "The results are bad news for researchers claiming that formal methods lend interpretability to systems. It might be true in some restricted and abstract sense, but not for anything close to practical system validation."
Interpretability is a critical aspect of AI development, as it is the foundation on which human trust in AI systems is built. When robots or AI systems can explain their actions, humans can decide whether they require adjustments or can be trusted to make fair and reliable decisions. An interpretable system also empowers developers and end-users to comprehend and trust the capabilities of AI. However, achieving interpretability has been a long-standing challenge in AI, as the inner workings of machine learning often remain a "black box" inaccessible to explanation.
Siu underlines the need for scrutiny in assessing interpretability claims, stating, "When researchers say 'our machine learning system is interpretable,' we need to start holding those claims up to more scrutiny."
The MIT Lincoln Laboratory research focused on whether formal specifications genuinely enhance the interpretability of AI systems. To evaluate this, they concentrated on people's ability to utilize these specifications for system validation, determining whether the system consistently met user goals.
Formal specifications are a subset of formal methods that use logical expressions as a mathematical framework to describe a model's behavior. Engineers often employ "model checkers" to mathematically confirm facts about a system's behavior using this framework. Researchers have attempted to leverage this framework to translate AI system behavior for human understanding.
Siu notes a key distinction: "Researchers confuse the fact that formal specifications have precise semantics with them being interpretable to humans. These are not the same thing." In the study, participants were tasked with validating a simple set of robot behaviors in a game of Capture the Flag. The results were disheartening, with an average validation accuracy of around 45% for all participants, regardless of how the formal specifications were presented.
Even individuals with expertise in formal specifications only marginally outperformed novices. However, experts exhibited more confidence in their responses, whether they were accurate or not. This confirmation bias is a cause for concern, as it could lead to overlooking failure modes in system validation.
The researchers emphasize the need for refinement in how formal specifications are presented to users and in the workflow in which they are applied. While acknowledging the complexity of rule-checking, Siu points out that the rule sets provided in the experiment were short and straightforward, considerably more superficial than what one would encounter in real-world systems.
The study does not directly correlate its findings with the performance of humans in validating real-world robot systems. Instead, the research aims to prompt a critical evaluation of the claims made by the formal logic community regarding interpretability and how these claims translate to practical applications.
This research is part of a broader initiative to improve the interaction between robots and human operators, particularly in military contexts. The project seeks to empower operators to teach tasks directly to robots, enhancing the robot's adaptability and the operator's confidence in the system.
As AI and autonomy become increasingly integrated into daily life and decision-making, the MIT Lincoln Laboratory researchers hope their study and ongoing research will contribute to advancing interpretability and trust in AI systems. In the words of Siu, "Our results push for the need to do human evaluations of certain systems and concepts of autonomy and AI before too many claims are made about their utility with humans."
